Windows keeps installing important updates for uninstalled Office 2010
I just uninstalled Office 2010 using the uninstaller and the Windows updater keeps installing important updates for it ~300 MB at a time. How do I stop this?

Which uninstaller did you use? The one in control panel > programs and features or something else? If programs and features you could try using the official Microsoft Fix it tool.

If still having issues you can try using the free 30 day trial version of Revo > forced uninstall option.

I ran the uninstaller in CCleaner and tried Fix It but it failed. I will install Revo now.
Edit: Office 2010 doesn't come up in Revo uninstaller.
Doesn't surprise me you're having problems uninstalling Office. It seems to put its hooks into many parts of the operating system and the registry. In my first link (above) scroll down to the "Remove Microsoft Office 2010 suites manually" section and open it by clicking on the + sign. It contains specific steps to (hopefully) remove all traces of Office. Strongly suggest you create a restore point before starting. If the worst happens you could restore your computer to the condition it is in now and be no worse off.
